Bluetooth: headphones connect, make a noise and shut down

I am trying to connect Sennheisers True Wireless Momentum 2 to a ZBook-Studio-x360-G5 running Ubuntu 20.4. Initially the device connects, then it makes a weird sound (like a video that is hung on a single frame when Windows crashes), the headphones restart, connect again and crash with the same sound again. That goes on in a loop. I have tried reinstalling pulseaudio, killing it, rebooting with no effect. I vaguely remember that I once fixed a similar issue with Momentum1 by changing some config files, but I can't find the solution now. The issue then was caused by the touch controls that the headphones have.
